Why is the variability of mean zero at the origin?

The answer to the question How to remove mean for a sample from population? gives the well-known fact, that the expected value of a statistic is zero if the corresponding population statistic is zero. The variability however seems to depend on the mean. For example, $f(X) = e^X$ has mean $\mu = \infty$ and variance $\sigma^2 = 0$, but the probability of $f(X)$ being in any interval of length $2$ is zero (and indeed, $f(X)$ has a point mass at $0$).
So my question is: Why does the variance of the expected value, $\text{Var}(\mathbb{E}(f(X)))$, depend on the mean, and can we say something about the influence of the mean on the variance?
